I'll admit, although I have seen a few matches here and there, my knowledge of wrestling is lacking in the Japanese Promotions. But from what I've seen, it's really interesting stuff, and I'm sure there's a ton of gem matches out there.
Can you give some recommendations on what I should check out?

What type of style would you like? There's the hard hitting, strong style stuff, the super fast paced Lucha inspired stuff, and the comedy stuff.
I'm by no means a Puro expert, but I've always dug KENTA, and I'm really digging Okada.
One thing I will recommend though is watching The Hiroshi Hase/Great Muta match that gave birth to the Muta Scale that gets brought up every now and then.

The only thing I really don't like are the deathmatches that were inspired off of promotions like FMW. Not saying that I don't like the bloody, violent style of wrestling, I've watched a ton of videos on ECW over the years. And believe me, there's some fairly decent brawls you can find if you look around, but there's one way of doing a deathmatch, then there's throwing your opponents into barbed wire wrapped cactus.

You can't go wrong with anything from the mid 90's in All Japan involving Misawa, Kawada, Kobashi, Hansen, or Williams.

Honestly, try anything from the New Japan junior heavyweight division in the last couple of years; specifically, try a few matches from the Best of the Super Juniors and see who interests you. Early matches are usually pretty short, and you can get a grasp of who has a style you like.
Specifically, watch a match with Kota Ibushi or Naomichi Marufuji. Chances are, you won't believe your eyes.

Try and get a comp of Keiji Muto 2001. Seriously. he was considered one of the greats in the late 80's early 90's - then towards the end of the 90's and in 2000 he was deemed a shell of himself due to his bad knees. He was even involved in Russo WCW.
Then out of nowhere - the guy shaves his head, gets a new look and has the best year of his life with several BLINDERS. Amazing really.
